Try taking the starter solenoid on the firewall off and clean it up. Had a similar problem and after a few trips to to Advanced Auto to test battery, alternator and then the starter. Did a few other things that failed but once I pulled and wire brushed the wall, solenoid and connectors. Put all back and engine started up. Have an 03 XLT V8 but I believe it's basically the same. Worth a shot. Good luck

Here is a video of what the truck sounds like.

Maybe I should mention I replaced the radio the day before, but it ran right after.

definitely get the new battery connectors on first - if they're not good they
they can give u some power but not enough to crank engine. IMO Good Luck

I can't get the starter out (I'll take a picture of the starter, it's rusted out and likely been going bad since before I bought it)

But there seems to be no way to get it out. It has the frame and brake lines in the way from the bottom and not enough space in general from the top. Any tips?

It sounds like theres no juice in the battery.... BUT if you suspect its a starter, get someone u derneath it and smack it with a hammer repeatedly while your trying to turn it over. The engine shiuld eventually turn over and maybe even start. If it does..or if it even sounds like its going to start...its your starter gone bad... replace starter.
